Point clouds obtained by 3D scanning or reconstruction are usually accompanied by noise. Filtering-based point cloud denoising methods are simple and effective, but they are limited by the manually defined coefficients. Deep learning has shown excellent ability in automatically learning parameters. In this paper, a filtering network named PointFilterNet (PFN for short) is proposed to denoise point clouds by the combination of filtering and deep learning. Instead of directly outputting denoised points using networks, PFN generates the filtering denoised points through learned coefficients. Specifically, PFN outputs three coefficient vectors. These coefficient vectors are then used to filter the coordinates of points in the neighborhood of the noisy point. PFN consists of two parts: an outlier recognizer and a denoiser, both of which generate different but indispensable filtering coefficients. The outlier recognizer reduces the interference of outliers by assigning small coefficients to them. The denoiser is designed to progressively denoise point clouds which accords to the perception process of the human visual system. The experiments on synthetic and real scanned point clouds demonstrate that PFN outperforms state-of-the-art point cloud denoising works. Compared with DMR, the Chamfer distance of PFN is reduced by 22.07% on PCN-dataset.

Sensor location awareness is a critical issue in internet of things applications. For more accurate location estimation, the two issues should be considered extensively: 1) how to sufficiently utilize the connection information between multiple nodes and 2) how to select a suitable solution from multiple solutions obtained by the Euclidean distance loss. In this paper, a DV-Hop localization based on the distance estimation using multi-node (DEMN) and the hop loss in WSNs is proposed to address the two issues. In DEMN, when multiple anchor nodes can detect an unknown node, the distance expectation between the unknown node and an anchor node is calculated using the cross domain information and is considered as the expected distance between them, which narrows the search space. When minimizing the traditional Euclidean distance loss, multiple solutions may exist. To select a suitable solution, the hop loss is proposed, which minimizes the difference between the real and its predicted hops. Finally, the Euclidean distance loss calculated by the DEMN and the hop loss are embedded into the multi-objective optimization algorithm. The experimental results show that the proposed method gains 86.11% location accuracy in the randomly distributed network, which is 6.05% better than the DEM-DV-Hop, while DEMN and the hop loss can contribute 2.46% and 3.41%, respectively.

The acquisition of point clouds is usually accompanied by noise due to imperfect laser scanning or image-based reconstruction techniques. Deep learning-based methods have achieved impressive performance in point cloud denoising. However, the features captured by a denoising network from noisy point clouds are usually contaminated by noise during training. The feature noise will lead to the oscillation of back-propagated gradients, which interferes with parameter optimization and reduces the denoising performance. In this paper, we propose to explicitly clean up feature noise for point cloud denoising from two aspects: feature noise cleaning and network training. From the first aspect, we propose the feature clean network (FCNet for short) to explicitly clean up the feature noise. From the second aspect, we train FCNet by a teacher-student learning model to learn the noise-free features under the guidance of feature domain losses. Specifically, FCNet is designed with emphasis on two modules: non-local self-similarity (NSS) and weighted average pooling (WAP). NSS module smooths features through a non-local filter based on the inherent non-local self-similarity of point clouds. WAP module applies original weights calculated by the statistical outlier removal algorithm to suppress the feature noise induced by outliers. In the teacher-student learning model, we introduce a clean input using the noisy point and its clean neighbors. The teacher network accepts the clean input to capture noise-free features. The student network is trained to imitate the teacher network to learn noise-free features by minimizing the feature loss. The experiments on synthetic and real scanned point clouds show that FCNet outperforms state-of-the-art point cloud denoising methods.

Audio-visual zero-shot learning (ZSL) has attracted board attention, as it could classify video data from classes that are not observed during training. However, most of the existing methods are restricted to background scene bias and fewer motion details by employing a single-stream network to process scenes and motion information as a unified entity. In this paper, we address this challenge by proposing a novel dual-stream architecture Motion-Decoupled Spiking Transformer (MDFT) to explicitly decouple the contextual semantic information and highly sparsity dynamic motion information. Specifically, The Recurrent Joint Learning Unit (RJLU) could extract contextual semantic information effectively and understand the environment in which actions occur by capturing joint knowledge between different modalities. By converting RGB images to events, our approach effectively captures motion information while mitigating the influence of background scene biases, leading to more accurate classification results. We utilize the inherent strengths of Spiking Neural Networks (SNNs) to process highly sparsity event data efficiently. Additionally, we introduce a Discrepancy Analysis Block (DAB) to model the audio motion features. To enhance the efficiency of SNNs in extracting dynamic temporal and motion information, we dynamically adjust the threshold of Leaky Integrate-and-Fire (LIF) neurons based on the statistical cues of global motion and contextual semantic information. Our experiments demonstrate the effectiveness of MDFT, which consistently outperforms state-of-the-art methods across mainstream benchmarks. Moreover, we find that motion information serves as a powerful regularization for video networks, where using it improves the accuracy of HM and ZSL by 19.1% and 38.4%, respectively.

Thanks to the remarkably expressive power for depicting structural data, Graph Convolutional Network (GCN) has been extensively adopted for skeleton-based action recognition in recent years. However, GCN is designed to operate on irregular graphs of skeletons, making it difficult to deal with other modalities represented on regular grids directly. Thus, although existing works have demonstrated the necessity of multi-modality fusion, few methods in the literature explore the fusion of skeleton and other modalities within a GCN architecture. In this paper, we present a novel GCN-based framework, termed GCNbased Multi-modality Fusion Network (GMFNet), to efficiently utilize complementary information in RGB and skeleton data. GMFNet is constructed by connecting a main stream with a GCN-based multi-modality fusion module (GMFM), whose goal is to gradually combine finer and coarse action-related information extracted from skeletons and RGB videos, respectively. Specifically, a cross-modality data mapping method is designed to transform an RGB video into a skeleton-like (SL) sequence, which is then integrated with the skeleton sequence under a gradual fusion scheme in GMFM. The fusion results are fed into the following main stream to extract more discriminative features and produce the final prediction. In addition, a spatio-temporal joint attention mechanism is introduced for more accurate action recognition. Compared to the multi-stream approaches, GMFNet can be implemented within an end-to-end training pipeline and thereby reduces the training complexity. Experimental results show the proposed GMFNet achieves impressive performance on two large-scale data sets of NTU RGB+D 60 and 120.

Audio-visual zero-shot learning (ZSL) has been extensively researched for its capability to classify video data from unseen classes during training. Nevertheless, current methodologies often struggle with background scene biases and inadequate motion detail. This paper proposes a novel dual-stream Multi-Timescale Motion-Decoupled Spiking Transformer (MDST++), which decouples contextual semantic information and sparse dynamic motion information. The recurrent joint learning unit is proposed to extract contextual semantic information and capture joint knowledge across various modalities to understand the environment of actions. By converting RGB images to events, our method captures motion information more accurately and mitigates background scene biases. Moreover, we introduce a discrepancy analysis block to model audio motion information. To enhance the robustness of SNNs in extracting temporal and motion cues, we dynamically adjust the threshold of Leaky Integrate-and-Fire neurons based on global motion and contextual semantic information. Our experiments validate the effectiveness of MDST++, demonstrating their consistent superiority over state-of-the-art methods on mainstream benchmarks. Additionally, incorporating motion and multi-timescale information significantly improves HM and ZSL accuracy by 26.2% and 39.9%.
